Abstract

Digital twin (DT) technology has been utilised in many applications including electric vehicles (EVs). A DT is a virtual representation of a physical object, enabled through real-time data integration, simulation, and optimisation tools. Unlike conventional simulations, which are typically offline and lack real-time interaction, a DT continuously synchronises with the physical system, enabling dynamic performance monitoring and predictive analytics. Achieving a full DT involves progressive stages, with the digital shadow (DS) being the final step before realising a bidirectional DT. Building a DS provides a scalable real-time performance monitoring and fault detection framework, enabling proactive decision-making in EV operations. This study introduces a DS system specifically designed to monitor the performance of a permanent magnet synchronous motor (PMSM) drive system in EVs, marking a critical phase towards a complete DT. The methodology for creating the DS is detailed, including the establishment of a comprehensive test bench for the EV powertrain as the physical reference model. The mathematical model of the EV-PMSM was formulated, and an advanced estimation model utilising the extended Kalman filter (EKF) was implemented. MATLAB/Simulink was employed to develop the motor's digital model. Real-time data acquisition from the physical model was facilitated through a data acquisition system (DAS) equipped with a controller area network (CAN) communication interface. The digital model underwent thorough validation against sensory data collected from the test bench. The motor digital model was deployed to a DS framework enabled through real-time data flow from the actual EV during real-world driving conditions. The results demonstrated a high accuracy of 97% between the DS predictions and the corresponding EV data, confirming the DS's reliability. These findings pave the way for future advancements, including bidirectional interaction and the realisation of a full DT.

1. Introduction

The fourth industrial revolution has significantly transformed how products are designed, manufactured, and maintained [1]. At the heart of this transformation lies digital twin (DT) technology, which provides a virtual representation of physical systems that can interact in real-time with their physical counterparts [2]. Electric vehicles (EVs) are increasingly important as a sustainable alternative to conventional internal combustion engine vehicles, driven by the need to reduce emissions and fossil fuel dependence [3]. The electric propulsion drive system, particularly the permanent magnet synchronous motor (PMSM), is the core component of an EV due to its high efficiency and excellent power density [4,5]. However, real-time performance monitoring of the PMSM drive remains a significant challenge, especially under varying driving conditions [6].

Achieving a full DT involves three stages: digital model (DM), digital shadow (DS), and finally digital twin (DT) [7]. In the DM stage, a virtual representation of the physical system is created without automated data flow. In the DS stage, a unidirectional data flow streams from the physical system to the virtual counterpart, enabling real-time monitoring and model validation. The final stage, the full DT, involves bidirectional data flow where the virtual system can influence the physical system [8]. This study addresses the DS stage, a critical step toward achieving a full DT for EV PMSM drives.

Several previous studies have addressed DTs for electric drive systems [9–15]. Rjabtšikov et al. [9] proposed a DT model for fault detection of a three-phase induction motor using an extended Kalman filter. Rassõlkin et al. [10] presented a data collection methodology for an AEV propulsion drive system. Venkatesan et al. [11] proposed a DT system for a PMSM drive for health monitoring and prognosis using machine learning. However, most of these studies focus on the full DT without systematically addressing the intermediate DS stage.

This research contributes to bridging this gap by presenting a comprehensive methodology for creating a DS for an EV PMSM drive system using a hybrid modelling approach that combines physics-based modelling with advanced state estimation techniques. The main objective is to develop a real-time monitoring framework that can track EV motor performance with high accuracy during real driving conditions.

2. Digital Shadow Methodology

The proposed DS methodology consists of four main stages: (1) establishing a physical reference model of the EV powertrain, (2) developing a mathematical model of the PMSM with a state estimation algorithm, (3) implementing a real-time data acquisition system, and (4) validating the digital model against physical data.

2.1. Physical Reference Model

A comprehensive test bench for the EV powertrain was established as the physical reference model. The test bench comprised a PMSM motor, an IGBT inverter, a battery pack, a control system, and a mechanical load simulating real-world driving conditions. The test bench was equipped with an array of sensors to measure key performance parameters including current, voltage, torque, speed, and temperature. A high-precision torque transducer and a power analyser were used to capture the motor response under various loading conditions. The test bench was operated through a set of predefined driving scenarios to ensure comprehensive coverage of operating conditions.

2.2. Mathematical Model of PMSM

The mathematical model of the PMSM was formulated in the rotating (d-q) reference frame. The model is described by voltage equations, magnetic flux equations, and the mechanical torque equation. The voltage equations in the d-q frame express the relationship between terminal voltage, terminal current, and motor parameters including resistance, inductance, and permanent magnet flux linkage:

Where Rs is the stator resistance, Ld and Lq are the d- and q-axis inductances, id and iq are the d- and q-axis currents, ωe is the electrical speed, and ψpm is the permanent magnet flux. The digital model was developed using MATLAB/Simulink, employing the Simscape Electrical library to ensure accurate representation of the motor's electromagnetic and dynamic characteristics.

2.3. Extended Kalman Filter for State Estimation

The extended Kalman filter (EKF) was implemented as the core estimation algorithm for the hybrid system. EKF is an advanced state estimation algorithm suitable for nonlinear systems, where the model is linearised around the current operating point. The EKF implementation involves two main stages: prediction and update. In the prediction stage, the PMSM mathematical model is used to forecast the next system state based on the current state and inputs. In the update stage, the predicted system state is corrected using actual sensor measurements. The Kalman gain matrix provides optimal weighting between the model and measurements based on the process and measurement noise covariance matrices.

Where x̂ is the estimated system state, u is the system input, K is the Kalman gain, z is the sensor measurement, and h is the nonlinear measurement function. The EKF covariance matrices were tuned experimentally to balance convergence speed and estimation smoothness under varying driving conditions.

2.4. Data Acquisition and Communication System

A data acquisition system (DAS) was implemented to collect real-time data from the physical model. The DAS is based on the controller area network (CAN) communication interface, a standard communication protocol in automotive applications. CAN allows highly reliable, low-latency data transmission between various electronic control units (ECUs) in the vehicle. The DAS was configured to collect multiple PMSM parameters including phase currents, DC-link voltage, motor temperature, rotational speed, and torque at a specified sampling frequency. The collected data were stored locally and streamed to the digital model for real-time processing.

3. Digital Model Validation

The digital model of the PMSM underwent a thorough validation process against sensory data collected from the physical test bench. The validation involved comparing the digital model outputs with actual measurements across a range of operating conditions. Model performance was evaluated using mean absolute error (MAE), mean absolute percentage error (MAPE), and root mean square error (RMSE). The digital model demonstrated excellent agreement with the physical data across all performance parameters, with an error margin below 3% across all tested conditions. The validation stage confirmed that the digital PMSM model can accurately represent the physical system behaviour under both steady-state and transient conditions.

4. Deployment and Real-World Driving Testing

Following successful validation on the test bench, the motor digital model was deployed to a DS framework enabled through real-time data flow from the actual EV during real-world driving conditions. The DAS was installed in a commercial EV to collect real driving data. The test route encompassed varied driving conditions including urban driving, highway cruising, and hilly terrain to ensure comprehensive coverage of real-world operating conditions.

The results demonstrated a high accuracy of 97% between the DS predictions and the corresponding EV data. The DS proved capable of accurately tracking phase currents, torque, and speed under dynamic driving conditions. The comparison of estimated versus measured PMSM currents showed high correlation, confirming the accuracy of the EKF-based state estimation. The system also demonstrated robustness by continuing to provide accurate estimates even during transient events such as sudden acceleration, deceleration, and abrupt load changes.

5. Discussion and Future Outlook

This study has demonstrated the feasibility of building a high-accuracy DS for an EV PMSM drive system using a hybrid modelling approach. The combination of physics-based mathematical modelling and EKF-based state estimation proved effective in achieving 97% accuracy. The developed DS represents a significant step toward realising a full DT, with potential scalability to other motor types and EV applications.

Future directions include: (1) developing bidirectional interaction to achieve a full DT where the virtual model can influence the physical system, (2) integrating machine learning techniques for adaptive state estimation that can learn from historical data and improve accuracy over time, (3) extending the DS scope to include the entire EV powertrain including battery and inverter, (4) implementing a DS-based fault detection framework for predictive maintenance, and (5) deploying the system on a cloud computing platform to enable remote monitoring and fleet analytics.

6. Conclusion

This paper introduced a DS system specifically designed to monitor the performance of a PMSM drive system in EVs, marking a critical phase towards a full DT. The methodology for creating the DS was detailed, including the establishment of a comprehensive EV powertrain test bench, the formulation of an advanced mathematical model with EKF, and the implementation of a CAN-based data acquisition system. Validation results demonstrated 97% accuracy between DS predictions and real-world data, confirming the reliability of the developed framework. These findings pave the way for future advancements towards realising a full DT for electric vehicles.
