Abstract
Industrial control networks based on Supervisory Control and Data Acquisition (SCADA) systems used in critical infrastructure require reliable, scalable, and generalizable attack detection mechanisms in the face of increasing cyber-threats. However, a large portion of the datasets commonly used in the literature are based on general-purpose network traffic and do not adequately reflect the cyclical, deterministic, and process-oriented communication structure of industrial protocols such as Modbus/TCP.
In this study, a completely isolated virtual SCADA environment was designed, and a SCADA-specific multi-class attack dataset called SCADANet was developed, containing 13 different attack scenarios generated concurrently with legitimate network traffic. A hybrid deep learning architecture consisting of parallel dilated Convolutional Neural Network (CNN) structures, Residual-SE blocks, and Long Short-Term Memory (LSTM) layers was proposed. Tested on both the SCADANet dataset and the widely used WUSTL-IIoT-2021 dataset, the model achieved 99.80% accuracy (macro-F1 98.65%) and 99.99% accuracy (macro-F1 97.70%) respectively, with markedly improved sensitivity in minority attack classes [11].
1. Introduction
Systems with critical infrastructure such as energy, healthcare, transportation, and financial services are essential for the natural flow of life. A large portion of such systems are managed using SCADA and Industrial Control System (ICS) technologies [1,2]. The ability to manage systems remotely creates a natural cybersecurity requirement, because the continuity of the services provided by critical infrastructure must be protected against external attacks [3].
A vulnerability in the system does not only cause a malfunction in the system itself; external factors connected to the system may also suffer damage [4]. Denial of Service (DoS) attacks and Advanced Persistent Threats (APTs) occur frequently, slowing down or obstructing operation [5,6]. Attack and anomaly detection in SCADA-based systems remains critical due to real-time operational requirements, low tolerance for false positives, and uneven traffic distributions, while attacks hidden within legitimate communication flows make reliable detection difficult under realistic conditions [7,8,9,10].
This study proposes a SCADANet dataset that realistically represents different SCADA-specific attack scenarios, together with a hybrid deep learning architecture capable of modelling multi-scale and temporal dependencies. Unlike prior approaches, the model is evaluated on both SCADANet and WUSTL-IIoT-2021, integrating parallel dilated Conv1D, Residual-SE blocks, and LSTM layers to represent multi-scale and feature-level contextual traffic. The main contributions are: (i) the SCADA-specific SCADANet dataset generated in a fully isolated virtual environment with Modbus/TCP traffic embedded in background traffic; (ii) rich multi-layer flow features including JA4+-based fingerprints; (iii) a novel hybrid architecture; (iv) a balanced two-stage optimisation with Focal Loss and class weights for imbalanced classes; and (v) cross-dataset generalizability.
2. Background and Literature Review
Cyberattacks targeting ICSs, particularly SCADA systems, are increasing and strike different points of such systems: reconnaissance attacks map the architecture with network scanners [12]; command and measurement injection sends deceptive commands that can cause physical damage and interruptions; DoS attacks flood the system with unnecessary traffic [13]; malware seeks unauthorised access to steal data or disrupt operations [14]; hijacking and blackout attacks aim to seize control and shut the system down; replay and fragmentation attacks resend captured packets to interrupt processes [7,16]. Legacy industrial protocols lacking encryption, authentication, and integrity checks — notably Modbus/TCP — together with ARP-spoofing-enabled man-in-the-middle attacks, make these systems vulnerable to protocol-based attacks [15,18,19,20].
Traditional detection comprises signature-based intrusion detection systems (IDSs), rule-based systems, and anomaly-based statistical models. Signature-based IDSs detect known attacks with low false-positive rates but fail against zero-day and novel techniques [13,28,29,30]. Rule-based systems built on expert knowledge can succeed in specific operations [31] yet weaken against evolving threats and require constant rule updates [16,32]. Statistical anomaly-based methods flag deviations from normal behaviour and detect novel attacks better, suiting dynamic SCADA environments [33], but natural flows are easily mistaken for threats, producing false positives [7,34,35].
Machine learning methods — Support Vector Machines, Decision Trees, Random Forest, k-NN, and XGBoost — outperform traditional ones, with ensemble approaches detecting volumetric attacks such as DDoS in SDN-based SCADA systems with high performance [36], and feature selection shown to strongly drive performance, often exceeding 90% accuracy [37,38,39]. Deep learning methods add further power: CNNs are computationally efficient but limited in long-range sequential relations [42,44,45]; LSTMs capture sequence-structured representations with strong recall [43,46,47,48]; autoencoders learn latent representations of abnormal traffic [49]; Transformers capture long-range dependencies [50]. Each model exposes distinct contextual attributes, motivating hybrid, multi-scale architectures that combine their strengths (Tables 2–3) [53,54,55,56].
3. Materials and Methods
Raw packets captured from the virtual SCADA network were aggregated into bidirectional flows with multi-layer attributes: packet-level statistics, TCP flag behaviour, timing characteristics, and JA4+-based fingerprint features capable of distinguishing low-volume attacks hidden in normal traffic. Flows were cleaned, normalised, and encoded into fixed-size traffic representations preserving both spatial feature patterns and sequential order, with stratified splits keeping minority attack classes represented in training and test partitions.
The proposed architecture processes each traffic representation through three complementary stages. First, parallel dilated Conv1D branches with different dilation rates extract short- and long-range spatial features simultaneously, capturing both bursty flood patterns and subtle single-packet anomalies. Second, Residual-SE (Squeeze-and-Excitation) blocks recalibrate channel-wise feature responses, amplifying discriminative feature maps while residual connections preserve gradient flow in deeper layers [72,73,74,77]. Third, LSTM layers model feature-level sequential and contextual dependencies across the flow, learning the deterministic, cyclical orderings characteristic of Modbus/TCP polling cycles [78,79,80].
Training uses a two-stage optimisation to counter severe class imbalance: class-weighted Focal Loss focuses learning on hard, minority-class examples while down-weighting easy majority flows, followed by fine-tuning with reduced learning rates. Regularisation combines batch normalisation [76], dropout, and early stopping on macro-F1. The same training protocol, hyperparameter search budget, and stratified five-fold cross-validation were applied to all baseline models (KNN, linear SVM, logistic regression, Gaussian NB, MLP, CNN1D, LSTM) to ensure fair comparison.
Two datasets ground the evaluation. SCADANet was generated in the isolated virtual laboratory (Ubuntu sniffer at 192.168.119.130, Kali attackers, Modbus server/client nodes) with 486,714 labelled flows across 13 attack scenarios — TCP-SYN/ACK floods, UDP/ICMP/HTTP floods, SQL injection, port/vulnerability/OS scans, Modbus false data injection, Modbus command abuse, APT exfiltration, and insider sabotage — embedded concurrently in legitimate Modbus/TCP traffic (Table 6). The public WUSTL-IIoT-2021 dataset [11,81] provides an independent benchmark with DoS, reconnaissance, and injection attacks against IIoT communication.
4. Experimental Work and Results
On SCADANet, five-fold averaged results reach 99.80% accuracy with macro-precision 98.63%, macro-recall 98.70%, and macro-F1 98.65% (Table 7). Per-class analysis shows the largest gains in minority classes — Modbus command abuse, APT exfiltration, and insider sabotage — where the Focal Loss weighting lifts recall by double-digit margins over the unweighted baseline, confirming that sensitivity is improved precisely where data are scarcest.
On WUSTL-IIoT-2021, the identical architecture achieves 99.99% accuracy with macro-precision 97.79%, macro-recall 97.68%, and macro-F1 97.70% (Table 7), surpassing the strongest published baselines on that dataset: DeepFM at 98.72% [88], CNN+Transformer at 98.75% [89], Transformer+GAN+AE at 97.86% [90], and AOA-SMA+Enhanced GRU+Attention at 97.90% [91] (Table 10). Against classical baselines evaluated under the same protocol, the proposed model leads on both datasets — e.g. macro-F1 98.65% vs 92.43% (LSTM) and 92.32% (KNN) on SCADANet (Table 11).
The ablation study (Table 8) confirms that every component contributes meaningfully and complementarily: removing the Residual-SE block drops macro-F1 from 98.65% to 98.30%; removing the dilated CNN drops it to 97.84%; removing the LSTM drops it to 97.33% — the largest single degradation, underscoring the importance of sequential modelling for cyclical SCADA traffic.
Complexity analysis shows inference latency compatible with near-real-time deployment on commodity GPU hardware, with SHAP-style decision analysis linking predictions to intelligible flow features (e.g. abnormal Modbus function-code sequences, anomalous inter-arrival times), supporting operator trust and forensic review (Sections 4.13–4.15).
5. Discussion
Compared with recent SCADA and IIoT studies (Table 9) — GAN-LSTM on SwAT at 87% [82], GAT-AD on WADI at 86.69% precision [83], ESML on BATADAL at 96.93% [84], CNN ensembles on MSU data at 96.6% [85], RF/SVM on CIC Modbus at 95% [86], and Transformer+FedNova on Edge-IIoTset at 98% [87] — the proposed multi-component approach achieves the highest reported accuracy while covering the broadest attack spectrum (13 classes spanning flooding, web, reconnaissance, SCADA-specific, APT, and insider threats).
The cross-dataset evaluation is the study's key methodological differentiator: only the proposed method combines public-dataset validation, a newly created SCADA dataset, ablation analysis, and multi-scale, attention, and temporal modelling simultaneously (Table 10). The consistent macro-F1 above 97.6% on two structurally different datasets indicates genuine generalisation to SCADA traffic characteristics rather than overfitting to a single capture environment.
6. Conclusions and Future Work
This study demonstrates that a multi-component deep learning architecture — parallel dilated CNNs, Residual-SE blocks, and LSTM layers — effectively models SCADA-specific traffic characteristics and delivers stable, high-sensitivity attack detection across data sources, reaching 99.80% accuracy on the newly created SCADANet dataset and 99.99% on WUSTL-IIoT-2021. The findings constitute both a methodological contribution (SCADA-faithful dataset design with concurrent attack embedding and JA4+ fingerprinting) and an experimental one (state-of-the-art results with verified component contributions).
Limitations include evaluation on two datasets with lab-generated background traffic and offline inference. Future research should pursue online deployment in live substations, integration with federated learning across operators, adversarial robustness of the fingerprint features, and extension to additional industrial protocols such as DNP3, IEC 61850, and OPC UA.
